I'm not sure if it would or not. Check the data sheet for the temperature tolerance of the LED.
You could probably just mush one into the clay with some powder on it so it would release and yank it back out before baking then glue it back in afterward. Still troublesome to do with such a little thing though.
Cute little thing. Translucent clay with sparkles does look neat.
